Skip Qwen3.8's QSA indexer loop during calibration when it keeps every token - #3008
Transformers' Qwen4ExpTextQSAIndexer (Qwen3.8, model type qwen4_exp) picks each query's attended tokens in a Python loop over every (sample, query) pair. On Qwen3.8-Flash-Next that is 524K iterations, about 340 s, per forward of 1,024 x 512 calibration tokens, on each of its 12 full-attention layers. Layerwise calibration runs each layer about twice, so the loop alone adds about two hours to a calibration that otherwise takes well under one.
A query keeps its indexer_budget // indexer_compress_ratio best complete key blocks plus the incomplete tail. So when the keys hold no more blocks than that, the query keeps every visible token, and the indexer's output equals the visibility mask it was given. With Qwen3.8-Flash-Next's 2,048-token budget, that covers every --calib_seq up to 2,048.
modelopt/torch/models/qwen4_exp/qsa_indexer.py: prepare_for_calibration gives each indexer instance of the model a forward that returns that mask directly when every visible key fits. It binds it with bind_forward_method, so an Accelerate hook from a device_map load still wraps it, bit-identical to the loop, and calls the original forward otherwise. It still runs index_qk_proj once, as the reference does, so a recipe that quantizes that projection's input still calibrates it. With a cache, it appends the step's indexer keys first. Nothing is patched at class level.
modelopt/torch/models/hf.py dispatches qwen4_exp and qwen4_exp_text to it, and now lets a model plugin define only the hooks it needs, prefers_bundled_code included; until now each plugin had to define all of them.
modelopt/torch/models/qwen4_exp/specs.py registers the model type, as every model package does. It records only model_type and min_transformers_version (5.16, the first release with qwen4_exp); the fused MoE layout is left undeclared, so export and quantization behave as before for this model.
hf_ptq.py already calls prepare_model_for_calibration, so it picks this up with no flag.
Also carries a fix for #3043, which merged before it could land there. imatrix's per-GPU encode workers ran without the caller's inference mode, which like grad mode is per thread. So encoding weights that are inference tensors under torch.inference_mode() failed with "Inplace update to inference tensor outside InferenceMode is not allowed". Each worker now enters inference mode when the caller is in it, and no_grad otherwise.
Usage
No API change. Library users calling mtq.quantize directly can apply it the same way:

Qwen3.8-Flash-Next on 4x GB300 (oci-jhb): single-pass IQ2_XXS imatrix on the routed gate_up experts, 1,024 x 512 calibration tokens, flash-linear-attention installed, no other patch. main here includes Encode each GPU's imatrix weights in its own thread #3043:

The loop costs about 76 min per forward over the calibration data. The rest of the 94-minute gap is the batch-size probe and the KL-scoring forward, which also run it on main. A layerwise run forwards each layer about twice, so it saves about twice the forward time; earlier layerwise runs measured 374 s instead of 33 s per pass on each full-attention layer.
The two KLs differ by +0.0014 ± 0.0017 (p 0.11, paired per chunk), which is not significant. This PR's indexer output is bit-identical to the loop's, as the unit test checks, and on the code before Encode each GPU's imatrix weights in its own thread #3043 the same comparison was identical token by token (0.287096 both). The difference here is most likely run-to-run variation in main's 80-minute reference-loop forward; a rerun is checking that. These runs predate the projection fix, which adds one small linear per full-attention layer.
Layerwise GPTQ equivalence: this PR alone vs main with the class-level patch our campaign used, 45:15 vs 45:43 layerwise, KL 0.249200 identical per token.
New CPU test test_qsa_indexer_fast_path_matches_the_reference compares the patched indexer with Transformers' reference on bool and float masks, left and right padding, an incomplete key tail (62 tokens), and with a real indexer cache, whose accumulated keys must also match. Within the budget it fails if the loop runs, through the class forward or through the forward the plugin saved. Over the budget it checks that the loop's result comes back. It also counts index_qk_proj calls, which must be one as in the reference.
New CPU test test_qsa_indexer_decoding_past_the_budget_matches_the_reference: prefill 30 tokens, then decode one token at a time to 42 with a 32-token budget, so the indexer moves from the fast path into the loop at 36 keys. Every step and the final cached keys match an unpatched copy.
New CPU test test_qsa_indexer_fast_path_runs_inside_an_accelerate_hook: a real Accelerate hook attached before preparation still runs around the fast path.
Planting each bug these tests target makes them fail: assigning forward directly, always delegating to the loop, using the fast path past the budget, or skipping the cache update.
New CPU test test_loading_hooks_the_plugin_lacks_keep_their_defaults: for qwen4_exp and qwen4_exp_text, prefers_bundled_code and checkpoint_has_mtp return their defaults. Without the optional-hook fix, prefers_bundled_code raises AttributeError.
tests/gpu/torch/quantization/test_ggml_imatrix_gpu.py now runs with and without inference mode; on 2 GPUs the inference-mode case fails without the Encode each GPU's imatrix weights in its own thread #3043 fix and passes with it.
tests/unit/torch/models/, tests/examples/hf_ptq/test_hf_ptq_args.py and test_example_utils.py: 300 passed. tests/unit/torch/quantization/test_ggml_imatrix.py and plugins/test_fused_experts.py pass too.

Calibration can process eligible Qwen4-Exp inputs faster while preserving results; inputs that exceed the supported budget retain the existing behavior.
Bug Fixes
Quantization now preserves the caller’s inference-mode setting when work runs across multiple GPUs.
Improved coverage for calibration results, cached keys, and inference-mode behavior.

The change registers Qwen4-Exp model support and adds a calibration hook that replaces matching QSA indexer forwards. The replacement uses the saved reference path when the compressed key length exceeds block_topk; otherwise, it returns the visible mask and updates the cache when present. GPU encoding workers also preserve the caller’s inference-mode setting.

…y token
Transformers' Qwen4ExpTextQSAIndexer loops in Python over every (sample,
query) pair: about 340 s per forward of 1,024 x 512 calibration tokens on
each of Qwen3.8-Flash-Next's 12 full-attention layers, against 33 s with
it skipped. A query keeps its block_topk best complete key blocks plus the
incomplete tail, so when the keys hold no more blocks than that, the
selection is the visibility mask the indexer was given. The calibration
hook for model type qwen4_exp now gives each indexer instance a forward
that returns that mask directly, bit-identical to the loop, and runs the
loop otherwise. The hf.py dispatcher lets a model plugin define only the
hooks it needs.

The fast path returned the visibility mask without calling index_qk_proj
when no cache was passed. The reference calls it on every forward, so a
recipe that enables input quantizers on every linear (FP8, for example)
would leave that projection's input quantizer without calibration data
and export it uncalibrated (review). The fast path now runs the
projection once, as the reference does, and reuses its keys for the
cache.

Inference mode, like grad mode and the current device, is per thread, so
a worker encoding weights that are inference tensors failed with
"Inplace update to inference tensor outside InferenceMode" when the
caller ran imatrix under torch.inference_mode() (review). Each worker now
enters inference mode when the caller is in it, and no_grad otherwise.
The 2-GPU test runs both ways.

prefers_bundled_code, added on main after this PR opened, called the hook
unconditionally, so hf_ptq.py with trust_remote_code on a qwen4_exp
checkpoint raised AttributeError before loading: the Qwen3.8 plugin
defines only prepare_for_calibration (review). It now falls back to
False when the plugin lacks the hook, like the other plugin hooks.

Changes requested: the forward replacement bypasses Accelerate hooks, and the fast-path test does not actually guard against calling the saved reference.
Needs action:
Replace manual forward binding in qwen4_exp/qsa_indexer.py with the existing Accelerate-aware bind_forward_method, and add a hooked-indexer regression test; see inline comment.
Fix the reference-call guard in test_qwen4_exp_qsa_indexer.py and extend equivalence coverage to incomplete tails and incremental decoding across the budget; see inline comments.
Remove benchmark numbers from qsa_indexer.py docstrings, keeping the equivalence explanation concise as required by CONTRIBUTING.md.

Bot comment.
The indexer may already have an Accelerate-wrapped forward: hf_ptq.load_model() installs this plugin after get_model() loads with device_map="auto"/"sequential" or offload options. Assigning module.forward directly removes that wrapper from the in-budget path, bypassing its pre/post hooks; it also leaves Accelerate's _old_forward pointing at the unpatched implementation. The repository already solves this in modelopt/torch/utils/network.py::bind_forward_method, which updates _old_forward while retaining the outer hook wrapper. Please use bind_forward_method(module, _forward, "_modelopt_reference_forward") here and cover an indexer with a real Accelerate hook attached before preparation.
The reason will be displayed to describe this comment to others. Learn more.
Fixed in 18e5989: prepare_for_calibration now binds the fast path with bind_forward_method(module, _forward, "_modelopt_reference_forward"), so a hook already on the indexer, such as one from a device_map load, still wraps it. New test_qsa_indexer_fast_path_runs_inside_an_accelerate_hook attaches a real accelerate.hooks.ModelHook before preparation and checks that it runs on the fast-path call and that the output still matches; with the old direct assignment it fails.

This patches the class method after prepare_model_for_calibration() has saved the original bound method as model.indexer._modelopt_reference_forward. Changing the class attribute does not change that saved callable. A replacement forward that always delegates to _modelopt_reference_forward would therefore still pass these equality/projection-count checks while running the expensive loop. Patch the instance's _modelopt_reference_forward with the raising sentinel for in-budget cases instead, and verify that deliberately forcing delegation makes the test fail.
The reason will be displayed to describe this comment to others. Learn more.
Fixed in 18e5989: in-budget cases now replace both the class forward and the instance's saved _modelopt_reference_forward with the raising sentinel (_forbid_the_loop). I checked it by making the fast path always delegate to the saved forward: the four in-budget cases and the hook test fail.
The reason will be displayed to describe this comment to others. Learn more.
Bot comment.
The cache case only verifies the first append: this stub returns the current keys rather than accumulated keys, and every case uses a 64-token length divisible by the compression ratio. The patch remains installed during hf_ptq.py's generation previews, so subsequent cached decode calls can cross from the fast path into the reference path. Please extend the existing parametrized equivalence test with non-divisible lengths and a real accumulated cache across that transition, comparing both outputs and cache contents against an unpatched indexer.
The reason will be displayed to describe this comment to others. Learn more.
Fixed in 18e5989. The stub is gone: cache cases use a real Cache(layers=[DynamicIndexedLayer()]) and compare the accumulated indexer keys. A new incomplete_tail case runs 62 tokens (15 key blocks plus a 2-token tail). New test_qsa_indexer_decoding_past_the_budget_matches_the_reference prefills 30 tokens and decodes one token at a time to 42, past the 32-token budget, so the indexer moves from the fast path into the loop at 36 keys. It compares every step and the final cached keys with an unpatched copy. Forcing the fast path past the budget, or skipping the cache update, fails it.

CONTRIBUTING.md explicitly places benchmark numbers in the PR description rather than source docstrings. Please remove the 340-second/1,024×512 timing detail here; retain only the concise complete-block/incomplete-tail argument needed to explain the guard.
The reason will be displayed to describe this comment to others. Learn more.
Fixed in 18e5989: the timing is out of the docstring, which keeps only the complete-block/incomplete-tail argument for the guard. The numbers stay in the PR description.
Review (meenchen):
- Bind the fast path with bind_forward_method instead of assigning
forward, so an Accelerate hook a device_map load already put on the
indexer still wraps it and moves its inputs.
- The equivalence test now also forbids the forward the plugin saved,
not only the class forward, so a fast path that always delegated to
the loop would fail.
- Cover an incomplete key tail, a real accumulating indexer cache, and
decoding that crosses from the fast path into the loop, comparing
every step and the cached keys with an unpatched indexer.
- Drop the timing from the docstring; it belongs in the PR description.
